Study Area
The research focuses on the Vavuniya District, located in the Northern Province of Sri Lanka. This region is characterized by its semi-arid climate, limited surface water resources, and a high dependency on groundwater for domestic and irrigational purposes. The district’s geology, comprising various sedimentary formations and alluvial deposits, makes it an ideal case study for applying advanced GIS and machine learning techniques for groundwater assessment.
Methodology
Data Collection
Spatial and Thematic Data
Data will be collected from various sources including satellite imagery, topographical maps, geological surveys, land use maps, soil maps, and meteorological records. Key datasets include:
- Geological maps and soil type classifications
- Digital Elevation Models (DEMs) for deriving slope and drainage patterns
- Remote sensing imagery capturing land use/land cover changes
- Rainfall, temperature, and hydrological records from local meteorological departments
- Borehole and well data recorded over several years
Data Preprocessing
The collected datasets will undergo georeferencing and normalization to ensure compatibility. Thematic layers will be created corresponding to each influential factor. Image correction techniques and data enhancement methods will be applied to improve the quality of satellite imagery.
Machine Learning Techniques
Feature Selection
Feature selection methods will be applied to identify significant parameters that influence groundwater potential. Statistical analyses and correlation studies will help in reducing redundancy and improving model efficiency.
Algorithm Implementation
Multiple machine learning models will be implemented to predict groundwater potential:
- Random Forest: Utilized for its robustness in handling non-linear relationships and high-dimensional data.
- Support Vector Machine (SVM): Employed for its proficiency in classification problems to delineate potential zones based on spatial features.
- Boosted Regression Trees (BRT): Applied to enhance prediction accuracy by combining multiple weak prediction models.
Model Training and Validation
The dataset will be split into training (70%) and validation (30%) subsets. Each model will be trained using the training dataset and validated with the remaining data. Accuracy metrics such as precision, recall, overall accuracy, and the area under the ROC curve (AUC) will be employed to evaluate model performance.
GIS Integration and Mapping
Database Development
A comprehensive GIS database will be established by integrating all thematic layers. This database will serve as the foundation for spatial analysis and further model training.
Groundwater Potential Zone Mapping
The machine learning outputs will be overlaid on the GIS database to produce a detailed groundwater potential zone map. Areas will be classified into categories such as very low, low, moderate, high, and very high potential zones. Spatial analysis tools in software such as ArcGIS or QGIS will be utilized to visualize and analyze these zones.
Accuracy Assessment
Validation Against Field Data
The model will be validated using independent field data obtained from existing well records and borehole logs. A cross-validation approach will be used to compare predicted zones with observed groundwater levels. Discrepancies will prompt refinement and recalibration of the model.
Performance Metrics
Quantitative assessments using confusion matrices and ROC curves will help determine model performance. The following table summarizes the planned evaluation metrics:
| Evaluation Metric | Description |
|---|---|
| Accuracy | Proportion of correctly classified samples |
| Precision | Ratio of true positives to combined true and false positives |
| Recall (Sensitivity) | Ratio of true positives to actual positives |
| AUC | Area under the ROC curve representing model discriminative ability |
